Implementing Face Verification with PyTorch and FaceNet

A robust face recognition pipeline generally comprises three core components: a detection module, a feature extraction engine, and a matching classifier. The process begins with locating facial regions within an input image. Once detected, these regions of interest (ROI) are passed to the recognition module, which outputs a set of feature vectors. Finally, a classifier compares these vectors to determine identity matches.

The recognition component often utilizes FaceNet, an architecture originally developed by Google. This model maps facial images into a 128-dimensional Euclidean space. Identity verification is performed by calculating the Euclidean distance between the feature vector of an input face and those stored in a database. If the distance falls below a predefined threshold, the faces are considered to belong to the same individual. Published at CVPR 2015, this algorithm leverages the principle that embeddings of the same person exhibit high cohesion across different poses, while embeddings of different people remain distinct. On the LFW dataset, this approach achieves accuracy rates exceeding 99%.

The core objective is to train a neural network that gneerates discriminative features. Quality is defined by two criteria: minimizing the distance between embeddings of the same individual and maximizing the distance between embeddings of different individuals. During inference, the system computes features and applies a distance threshold to verify identity.

Implementation can be achieved using the facenet-pytorch library. Installation is handled via pip. The following example demonstrates a class-based structure for handling detection and verification.

import torch
import cv2
from facenet_pytorch import MTCNN, InceptionResnetV1

class FaceVerificationSystem:
    def __init__(self, threshold=0.85):
        self.device = torch.device('cuda' if torch.cuda.is_available() else 'cpu')
        # Initialize MTCNN for detection
        self.detector = MTCNN(min_face_size=20, keep_all=False, device=self.device)
        # Initialize InceptionResnetV1 for embedding generation
        self.encoder = InceptionResnetV1(pretrained='vggface2').eval().to(self.device)
        self.threshold = threshold

    def generate_embedding(self, image_path):
        img = cv2.imread(image_path)
        if img is None:
            raise ValueError("Image file not found")

        # Detect face and return tensor
        face_tensor = self.detector(img)
        if face_tensor is None:
            return None

        # Ensure correct shape for model input
        if face_tensor.dim() == 3:
            face_batch = face_tensor.unsqueeze(0).to(self.device)
        else:
            face_batch = face_tensor[0].unsqueeze(0).to(self.device)

        with torch.no_grad():
            embedding = self.encoder(face_batch)

        return embedding.cpu()

    def verify(self, path_ref, path_target):
        emb_ref = self.generate_embedding(path_ref)
        emb_target = self.generate_embedding(path_target)

        if emb_ref is None or emb_target is None:
            print("Face detection failed in one of the images.")
            return False

        # Calculate Euclidean distance
        dist = torch.norm(emb_ref - emb_target).item()
        print(f"Calculated Euclidean distance: {dist:.4f}")

        return dist < self.threshold

if __name__ == "__main__":
    verifier = FaceVerificationSystem(threshold=0.85)

    # Replace with actual image paths
    is_match = verifier.verify('subject_a.jpg', 'subject_b.jpg')

    if is_match:
        print("Verification Successful: Identities match.")
    else:
        print("Verification Failed: Identities do not match.")

Upon initial execution, the system will download the pretrained VGGFace2 weights. This process may take some time depending on network speed. The InceptionResnetV1 model supports pretrained weights from both VGGFace2 and CASIA datasets. To avoid repeated downloads, pretrained checkpoints can be manuallly placed in the default PyTorch cache directory typically located at ~/.cache/torch/checkpoints.

When executed, the script outputs the generated feature vectors and the calculated distance. If the distance is below the configured threshold, the system confirms a match; otherwise, it indicates distinct identities.
